Adversarial Machine Learning for ~~fun and~~ Profit#

Introduction#

Machine Learning Security is having a moment. Once purely-academic research, the field is increasingly applied with maturing toolsets used to probe and assess increasingly popular and “production” products and services. For professionals, much of the focus has been on “security critical” applications. In situations with the highest impact, how can we ensure AI solutions are secure? These security researchers have broadly focused on achieving outcomes by “stealing” models or data through various levels of access (training data extraction, inference attacks, or model extraction) or “influencing” model’s decisions through attacks at various phases during the machine learning development process. However this is a relatively narrow set of use-cases and I posit that the recent increase in performance and popularity of many AI solutions will expand the applications of AI security techniques in new (revenue-generating) directions.

In the Beginning: Search Engine Optimization#

Search engine optimization can be viewed as a specific case of targeted evasion against recommender systems. That is to say: in a pristine environment, the recommender sorts and recommends items based purely on 1) the material content and 2) the user profile. But there’s money to be made, so why leave that all up to “the algorithm”? For years now, content creators and marketing teams have developed solutions for “hacking” these recommender systems to make it more likely that users will see their content (html tags, “like and subscribe”, specific thumbnails, specific video lengths). These are specific steps that creators took to shift the recommendation result to either be higher or to different demographics, a targeted (only up, never down) evasion of the system. These patterns will only accelerate.

LLMs#

As of this writing, LLMs have been trained on “the naive internet” – a massive pool of data mainly populated by actors unaware that they were contributing to a training dataset. Savvy actors are no longer ignorant. Whether intentionally through assistant-style interfaces or unintentionally through LLMs used in the backend of traditional search applications, consumers will be querying LLMs to help make purchasing decisions. Great, very helpful… but not the same, and not first-order controlled by the companies named. It’s entirely possible that a marketing executive at Bosch would be very disappointed that they’re only cited as having “a variety of wash cycles” instead of something more colorful and descriptive – not to mention that this great feature is omitted in the other chat. And the Samsung and LG execs? Not happy. The GE exec? Pack a bag. Based on the amount of capital currently spent on advertising, I’m sure that marketing teams will want to pursue “LLM Engine Optimization”. How can a third party do that when they don’t control the AI product or service? Adversarial Machine Learning techniques.

And Others#

How much would Coca-Cola pay to have every image you generate through Stable Diffusion or Midjourney include a coke bottle? Or maybe only images of happy, attractive people on the beach? Or every polar bear?

And Feeback Loops, oh my#

Potentially the most naive and easy-to-reason-about framing of these “attacks” would be dataset poisoning. Think of your objective and how you’d want to manipulate training data to bias the final AI system in that direction. On the scale of these massive models, that kind of influence would take oodles of data, right? Luckily for us and our advertising overlords, methods to generate oodles of tailored data have arrived. And what’s waiting for them? Years of research about the minimal amount of training data required to poison a system and ways you can do it at internet-scale.

There are also more interesting “attack paths” developing every day. An increasing number of these systems are exposing methods to extend the base model with access to external APIs. In the case of ChatGPT Plugins, those APIs are queried and return context that’s added to your query.

It’s a feature, not a bug – plugin, not prompt injection. These days are near (or maybe here already).

Conclusion#

Everyone is out to make a buck and advertising is (probably) an important function of business and society – make things discoverable, delight customers and so forth. As societies move from flyers in the town square to facebook ads to… whatever’s next, the techniques used to influence material presented to users and consumers adapt with them. The meta-problem for advertising is targeted evasion: How do I move someone from the class not going to buy my product to the class bought my product? How do I jump this decision boundary? How do I change the decision boundary? Great researchers have been working on these questions for years under the umbrella of “security”, but they may just have been optimizing the next wave of advertising all along.
